For instance, I’m relatively new to ML, and I’ve read that one of the most popular ML algorithms is decision trees (eg. CART, C4.5, Quinlan). It seems as if the the most-used implementation would be to keep the entire dataset in memory while training.\nHowever, I read the following paper, “Fast Training of Decision Trees.” They make the following claim (emphasis mine):<\/p>\n
It has been demonstrated that the memory requirement of CART is significantly smaller than the memory requirement of backpropagation;<\/p>\n
It’s also stated in this paper (p. 427):<\/p>\n
The memory requirement of CART is more lightweight than its nearest competitor, Quinlan’s version of C4.5.<\/p>\n
I was quite surprised by the claim. Can somebody explain why it would be so essential to keep all the data in memory while training? Also, can somebody explain why CART and other ML algorithms usually have to involve memory-intensive preprocessing? For instance, even though I was having some trouble with backpropagation while learning, I feel like they’ve been a lot more robust in most cases; they don’t involve preprocessing other than input preprocessing.<\/p>\n

I think one of the reasons you asked about memory usage is because tree-based algorithms are commonly used in areas where you need a model that can handle large datasets. For example, in image and text categorization problems, there can be tens or even hundreds of thousands of training examples with 100-1000 features each.\nIf you were going to use the model on training data, you could easily train the model on much smaller datasets if there were no memory constraints. However, often you want to use the trained model to predict examples that are not part of the training set – and that requires that you store all the training examples in memory.\nOne good reason for doing so is that tree-based models are the only ones I know of that can store the features for a dataset on disk while also being able to reconstruct features for new data as it arrives. This is useful because you can build a model that is much faster in some cases and scales to many more data points than the trained model, but still be able to access the old features and perform predictions from it. Because of this, I’d say tree-based algorithms are ideal for<\/p>\n
